WorldKV: Efficient World Memory with World Retrieval and Compression

A training-free framework for managing KV-cache memory in autoregressive video diffusion world models. Addresses the memory wall problem where long-horizon video generation accumulates unbounded KV-cache state, making inference infeasible over many frames.

Overview

Autoregressive video diffusion world models generate frames sequentially, conditioning each new frame on the full history of prior frames. The KV cache grows linearly with sequence length, quickly exhausting GPU memory. Prior approaches either drop older KV entries (losing scene consistency) or introduce expensive re-encoding of compressed latent states.

WorldKV solves this with two complementary, training-free mechanisms:

World Retrieval

World Retrieval treats the KV cache not as a monolithic FIFO buffer but as a retrieval-augmented memory store.

Mechanism

1. Chunking and Eviction

   • The KV cache is divided into fixed-size chunks (each chunk corresponds to a contiguous block of generated frames).
   • When a chunk would be evicted from the native attention window (due to context-length limits), it is not discarded. Instead, it is moved to an external memory store.

2. Dual-Level Storage Hierarchy

   • GPU memory store: A fixed-capacity buffer holding the most recently evicted chunks (fastest access).
   • CPU memory store: Overflow chunks are asynchronously swapped to host memory via background cudaMemcpyAsync transfers, overlapping with GPU computation.

3. Scene-Aware Retrieval via Camera/Action Correspondence

   • Each stored chunk is tagged with metadata: camera pose, action embedding, and frame timestamps from the world-model rollout.
   • At each new generation step, the current camera pose and action context form a query key.
   • A lightweight similarity search (cosine similarity over camera/action embeddings) selects the top-k most scene-relevant chunks from the store.
   • Retrieved chunks are directly injected as key-value pairs into the attention computation window — no re-encoding, no gradient computation.

4. Attention Integration

   • Retrieved KV pairs are concatenated with the native attention window's KV pairs before the attention softmax.
   • Standard causal masking is applied: retrieved chunks are treated as preceding context; new tokens attend to all retrieved + native context.
   • No architectural changes to the underlying diffusion transformer.

Why It Works

Video world models exhibit strong spatial and temporal locality — frames generated under similar camera trajectories and action sequences share substantial visual and latent structure. World Retrieval exploits this by making relevant historical context directly available to attention without forcing it through the context-length bottleneck.

World Compression

While World Retrieval decides which chunks to keep, World Compression decides what within each chunk to keep.

Mechanism

1. Anchor Frame Selection

   • Within each chunk, one frame is designated the anchor (typically the first or middle frame).
   • The anchor frame's key vectors serve as the reference distribution.

2. Token-Level Pruning via Key-Key Similarity

   • For every non-anchor frame in the chunk, each spatial token's key vector is compared against its corresponding spatial position in the anchor frame.
   • Similarity metric: Cosine similarity between key vectors at the same spatial location across frames.
   • Tokens whose keys are highly similar to the anchor (above a threshold τ) are pruned: their KV entries are dropped from the chunk's storage.

3. Storage Savings

   • Pruning halves per-chunk storage on average across diverse video datasets.
   • The anchor frame's full KV pairs are always retained to serve as the similarity reference at retrieval time.
   • The pruning mask (which tokens were kept) is stored as a compact bitfield per chunk.

4. Decompression at Retrieval

   • When a compressed chunk is retrieved, the pruning mask is applied to reconstruct the sparse KV set.
   • Decompressed chunks are padded to their original shape with zero-valued KV pairs (attention softmax naturally ignores zeros).
   • The reconstruction is a simple scatter operation — no neural decoding needed.

Redundancy Patterns Exploited

• Static background regions: Tokens corresponding to walls, floors, sky — nearly identical keys across frames.
• Slow-moving objects: Tokens that drift by sub-pixel amounts between frames; key similarity remains high.
• Repeated textures: Homogeneous regions (grass, water, sand) where spatial key distributions are nearly constant.

Throughput Analysis

WorldKV introduces three operations that affect end-to-end throughput: (1) chunk eviction/transfer, (2) retrieval similarity search, and (3) token pruning. The paper measures throughput on video diffusion world models of varying sizes.

• The CPU memory store provides effectively infinite capacity without GPU memory cost, enabling arbitrarily long rollouts.

Scaling Properties

• Chunk size C: Increasing C reduces retrieval frequency but increases per-chunk transfer cost. Optimal C ~ 8-16 frames.
• Top-k retrieval: k = 2-4 chunks provides most of the benefit; returns diminish beyond k = 8.
• Pruning threshold τ: τ = 0.85-0.95 (cosine similarity) achieves ~2× compression with <1% fidelity loss.
