# Bayesian Agent Orchestration ## Description Bayes-consistent orchestration methodology for multi-agent AI systems. Ensures probabilistic coherence when composing multiple agents, tools, and reasoning steps into larger workflows. ## When to Use - Designing multi-agent AI systems with composable agents - Building tool-calling frameworks for LLM agents - Analyzing reliability and uncertainty in agent chains - Implementing agent orchestration with uncertainty quantification - Evaluating agent composition strategies ## Core Principles ### Bayes Consistency An agentic orchestration is Bayes-consistent if the composed system posterior beliefs equal the Bayesian update of the prior given all observations, agent compositions preserve probabilistic coherence across steps, and tool calling decisions account for uncertainty in both agent predictions and tool outputs. ### Key Theoretical Results 1. **Composition theorem**: Sequential agent compositions maintain Bayes consistency iff each component update is Bayesian 2. **Tool calling optimality**: Optimal tool invocation balances information gain against computational cost 3. **Uncertainty propagation**: Agent uncertainty compounds multiplicatively in chains, additively in ensembles ## Orchestration Patterns ### Pattern 1: Sequential Bayesian Updates Each agent performs a proper Bayesian update. Composition preserves overall Bayes consistency. Use when agents process information sequentially. ### Pattern 2: Parallel Agent Ensembles Multiple agents observe different information. Combine via Bayesian model averaging. Use when diverse information sources are available. ### Pattern 3: Tool-Augmented Reasoning Agent must decide whether external tool call is worthwhile. Decision based on expected information gain vs cost. Use when agents have access to external tools or APIs. ## Implementation Guidelines 1. Maintain explicit uncertainty: Track probability distributions, not just point estimates 2. Calibrate confidence: Ensure agent confidence scores reflect actual accuracy 3. Propagate uncertainty: Pass uncertainty through agent compositions 4. Validate consistency: Test that composed system outputs match single-agent Bayesian updates ## Anti-Patterns to Avoid - **Confidence inflation**: Agent chains that produce overconfident outputs - **Information loss**: Discarding uncertainty when passing between agents - **Inconsistent updates**: Agents that do not properly condition on available evidence - **Tool over-calling**: Invoking tools without assessing information gain ## Verification 1. Test Bayes consistency on known distributions 2. Compare composed system vs single-agent baseline 3. Measure calibration of confidence scores 4. Validate that uncertainty propagation is correct ## References - Papamarkou et al. "Position: agentic AI orchestration should be Bayes-consistent" (ICML 2026, arXiv:2605.00742)
